The Local AI Revolution
Running open-source models like Llama 3.3, Mistral, and DeepSeek locally gives developers 100% data privacy, zero API rate limits, and zero recurring cloud inference bills. However, the first hurdle every developer faces is hardware: Will this model fit into my GPU's VRAM?
The Three Components of LLM VRAM Usage
Total GPU memory consumption during inference is divided into three distinct buckets:
- Model Weights Memory: The static memory required simply to load the neural network parameters into GPU VRAM.
- KV (Key-Value) Cache: The dynamic memory required to store attention states for every token in the active context window.
- Runtime & Activation Buffers: CUDA context overhead, PyTorch memory workspace, and intermediate activation tensors (~1.0 GB to 1.5 GB).
The Model Weight Formula
At full 16-bit precision (FP16 or BF16), each parameter occupies exactly 2 bytes of VRAM. A 70-billion parameter model requires:
70B × 2 bytes = 140 GB of VRAM (requiring dual 80GB A100 GPUs).
Quantization to the Rescue: 4-Bit (Q4_K_M & AWQ)
Quantization compresses floating-point weights into lower-bit representations with negligible perplexity loss. At 4-bit precision (Q4_K_M), each parameter requires only ~0.55 bytes:
- 8B Model: ~5.2 GB weights (runs easily on an RTX 3060 12GB or 8GB RTX 4060).
- 14B Model: ~9.1 GB weights (runs on a 12GB RTX 4070).
- 70B Model: ~40 GB weights (runs on dual 24GB RTX 3090/4090s or Apple M-series Macs with 64GB+ Unified Memory).
The Hidden Memory Killer: Long Context Windows
Many modern models support 64k to 128k context windows. However, attention KV caches scale linearly with context length and batch size. An 8B model at 128k tokens with FP16 KV cache can consume over 16 GB of VRAM solely for cache! To counter this, modern inference engines like vLLM and llama.cpp support FP8 and Q4 KV cache quantization, cutting cache memory by 50% to 75%.
